Went to super crap auto to get degreaser, thought I'd get brake caliper cleaner while I'm at it, didn't end up using it.

Keep it. It might sit in the corner for a few years, but you'll use it some day.

Brakes always get dirty, cleaning them never hurts.

I read up that some people avoided using it as it could damage the piston seals or some other fandangle pricey part

I used soapy water and a tooth brush to get most of the grime off
